I think you are right on the mark with that statement.
A couple of books that really stuck with me...Where the Wild Things Are - Maurice Sendak
A Sweetheart for Valentine - Lorna Balian
The Giving Tree - Shel Silvertein
Dinosaur Halloween - Liza Donnelly
:)
I don't remember many picture books when I was a kid, but here are some I loved:The Velveteen Rabbit captured my imagination; it made me cry.
Peter Rabbit intrigued but scared me. How awful it would be to get caught by mean old Mr. McGregor!
The Best Loved Stories and Poems for Little Children: I adored the rhythms of the words and the old-fashioned pictures.
The Childcraft Poetry book. Poems such as The Sugar Plum Tree; Wynken, Blinken, and Nod; and many, many others created warm moments of wonder in my young mind.

Beatrix Potter's books have a big scare factor for me too.
Velveteen Rabbit was very touching and reminds me of magical things of childhood.
The one book that really sticks with me is Struwwelpeter If you know the book you will understand why. My brother and I were fascinated with those drawings. Apparently the author/illustrator could find a decent children's book for his 3 year old son so he wrote and illustrated his own.

I believe that is the same book that The Office used when Dwight was reading to the kids in the conference room.

A Fly Went ByI can still quote passages from it! It's a lovely rhyming book that's easy for young children to read :)

Any of the Harry books.
"One Morning in Maine"
Later, "Harriet the Spy" and "Charlotte's Web"

Other books that stuck with me were some Beatrix Potter stories, which I found both fascinating and frightening (The Pie and the Patty Pan) and The Little Prince with its simple yet profound illustrations and story.
